When a mid-market financial services firm's data team was spending two days fulfilling every ad-hoc analytics request, leadership knew something had to change. Business users needed answers fast — revenue forecasts, customer segmentation breakdowns, compliance metrics — but every question required a SQL-literate analyst to write, validate, and run a query. The Problem: Data Access as a Bottleneck

In this case, the company had a well-structured data warehouse on Amazon Redshift with years of clean, governed financial and operational data. - Request submission: A business user emails or Slacks the analytics team with a question ("What was our Q3 revenue by product line, excluding returns?").

- Delivery: Results sent back. If the stakeholder has a follow-up question, the cycle restarts.

The Solution: Natural Language to SQL with Amazon Bedrock
EFS Networks designed and deployed a self-service analytics interface that lets business users ask questions in plain English and receive accurate SQL-generated results in seconds. The architecture combines several AWS services:

- Amazon Bedrock with Anthropic's Claude model handles natural language understanding and SQL generation
- Amazon Redshift serves as the data warehouse
- AWS Lambda orchestrates the query pipeline — receiving user input, calling Bedrock, validating generated SQL, executing against Redshift, and returning formatted results
- Amazon API Gateway provides the secure interface between the web frontend and Lambda
- Retrieval-Augmented Generation (RAG) via Amazon Bedrock Knowledge Bases stores schema documentation, business glossaries, and query examples so the model generates contextually accurate SQL
How RAG Makes It Accurate
The key to production-grade natural language to SQL is context. Without it, a language model doesn't know that "Q3" means July through September on a fiscal calendar, or that "active customers" excludes accounts in a 90-day grace period. RAG solves this by injecting relevant schema metadata, business definitions, and validated query examples into every prompt.
The knowledge base includes:
- Schema documentation: Table names, column descriptions, data types, and relationships
- Business glossary: Definitions of domain-specific terms ("net revenue," "churn rate," "active account")
- Query templates: Validated SQL patterns for common question types, which the model uses as structural references
- Guardrails: Rules that prevent queries against restricted tables or columns containing PII
Implementation: What It Actually Took
The project ran over eight weeks with a phased rollout:
Weeks 1-2: Schema mapping and glossary creation. This is the unglamorous but critical work. We documented every table and column the model would need access to, wrote plain-English descriptions, and catalogued business terminology. This phase determines accuracy — skip it, and you'll get syntactically valid SQL that answers the wrong question.
Weeks 3-4: Pipeline development. Lambda functions for query orchestration, Bedrock integration, SQL validation (syntax checking and guardrails before execution), and result formatting. We built a validation layer that catches common failure modes — ambiguous column references, missing joins, queries that would return millions of rows.
Weeks 5-6: RAG tuning and testing. We loaded the knowledge base, ran hundreds of test questions, and iteratively refined the schema documentation and prompt engineering based on failure analysis. Accuracy went from 72% on first attempt to 94% after tuning.
Weeks 7-8: User rollout and feedback loop. Deployed to a pilot group of 15 business users, collected feedback, refined the UI, and expanded to the full organization. Built a feedback mechanism so users can flag incorrect results, which feeds back into the knowledge base.
Results: The Numbers
After 90 days in production, the measurable outcomes were significant:
- 87.5% reduction in time-to-answer: From an average of 2 business days to 15 minutes, including the time users spend refining their questions

Lessons Learned
Schema Documentation Is the Product
The language model is only as good as the context you give it. Organizations that invest in clear, comprehensive schema documentation — not just technical metadata but business-context descriptions — see dramatically higher accuracy. This isn't a one-time effort; as tables evolve, the documentation must stay current.
Guardrails Are Non-Negotiable
In a financial services context, the system must never expose PII, execute destructive queries, or return results from restricted datasets. We implemented multiple layers: table-level access controls, column-level PII detection, query complexity limits (no full table scans), and result-set size caps. Every generated query passes through validation before execution.
Start Narrow, Expand Methodically
We began with five well-documented tables covering revenue and customer data. Once accuracy was proven, we expanded to 23 tables covering operations, compliance, and HR. Trying to cover the entire data warehouse from day one would have diluted accuracy and overwhelmed the documentation effort.
The Feedback Loop Is Essential
Users flag roughly 6% of results as incorrect or incomplete. Each flag is reviewed, and the fix — whether a glossary update, schema correction, or new query template — improves accuracy for all future queries. This continuous improvement cycle is what separates a demo from a production system.
When Does This Make Sense?
Natural language to SQL is not a universal solution. It works best when:
- You have a well-structured data warehouse with consistent naming conventions and documented schemas
- Your analytics team is bottlenecked by routine queries rather than complex analysis
- Business users need exploratory access — they don't know in advance what they'll want to ask
- Your data governance is mature enough to define clear access controls and business definitions
